Generative Simulation Benchmarking for bio-inspired soft robotics maintenance under real-time policy constraints

Description and use

A real‑time generative simulation pipeline for soft‑robot maintenance was built, combining a flow‑matching dynamics core, a benchmarking harness, and a policy gate that shares metrics to decide trustworthiness under 200 Hz constraints.

Problem

Soft‑actuator maintenance requires deciding if a robot is still operating within its designed regime, but soft actuators lack precise models and provide only coarse proprioception, making classical fault detection infeasible.

Outcome

The pipeline achieved a latency‑aware generative simulator that could run at 200 Hz with acceptable accuracy loss, enabling real‑time maintenance decisions for soft robots.

Workflow

  • 1. Design a conditional flow‑matching model (GRU encoder + MLP) to predict next latent state.
  • 2. Train with flow‑matching loss, conditioning on 8–16‑step history windows.
  • 3. Benchmark the model on rollout accuracy, distributional realism, and worst‑case latency.
  • 4. Distill the multi‑step teacher into a one‑step student via consistency‑style objective to meet 200 Hz latency.
  • 5. Verify accuracy degradation remains within maintenance‑acceptable tolerance.
  • 6. Deploy the student in a real‑time policy gate that uses the same metrics to decide on‑the‑fly whether to trust the prediction or use a conservative safety policy.

Evidence

Soft actuators bend, buckle, and exhibit nonlinear viscoelastic behavior that rigid‑body simulators simply cannot capture.

Source

The benchmark and the runtime gate should share the same statistical machinery.

Source

During my investigation of flow‑matching for this application, I found that conditioning on a short history window (8–16 timesteps) was critical.

Source

The raw flow model needed ~40 integration steps per prediction, which at 200 Hz was impossible.
